Touhou 15.
DO NOT START WITH THAT GAME. It's still one of the most fun touhou games though with arguably the best music and some of the best modern touhou characters. It's the most dificuly touhou game but beating it feels like you took on the world and won compared to other touhou games.
Also it has the best modern touhou character, Clownpiece.

Touhou 12, it's an actually engaging touhou with a very well implemented mechanic, though it is pretty difficult and bullshitty, especially to a newcomer as you have to get used to it and memorize the UFO token patterns, aka routing.
If you wanna start somewhere, try either 7 or 6; 7 has the cherry mechanic which is basically a free hit tank, and 6 is as vanilla as possible since it doesn't use any crazy gimmicks like the other games do, so you're playing the raw experience.

Y'know, i hate that you're right, because anything past 15 has forgettable characters.

Silly Ghost Princess
I've only completed Touhou 6-8 and 10, and I find it to be a close contest between Perfect Cherry Blossom and Imperishable Night. PCB is a pretty forgiving game (my personal choice for newcomers) and has what I believe to be the best cast of characters, while Imperishable Night is just extremely fun to play and has a killer soundtrack amongst the other Touhou games.
